    چکیده:

    طبقه‌بندی پوشش اراضی شهری یکی از مهم‌ترین کاربردهای سنجش از دور و پردازش تصاویر ماهواره‌ای است که نقش اساسی در برنامه‌ریزی شهری، مدیریت منابع، توسعه پایدار، پایش تغییرات محیطی و تصمیم‌گیری‌های مدیریتی ایفا می‌کند. با رشد سریع شهرنشینی و افزایش نیاز به اطلاعات مکانی دقیق، تهیه نقشه‌های به‌روز و دقیق از پوشش اراضی شهری اهمیت روزافزونی یافته است. این اطلاعات امکان شناسایی وضعیت موجود، تحلیل روند توسعه شهرها، مدیریت زیرساخت‌ها، کنترل تغییرات کاربری اراضی و حفاظت از محیط‌زیست را فراهم می‌کنند. ازاین‌رو، استفاده از فناوری‌های نوین سنجش از دور و الگوریتم‌های هوشمند برای افزایش دقت استخراج اطلاعات از تصاویر ماهواره‌ای، به یکی از مهم‌ترین موضوعات پژوهشی در حوزه علوم ژئوماتیک و سنجش از دور تبدیل شده است.

    در سال‌های اخیر پیشرفت چشمگیر سنجنده‌های ماهواره‌ای و توسعه تصاویر با قدرت تفکیک مکانی، طیفی و ارتفاعی بالا، فرصت مناسبی برای استخراج دقیق‌تر اطلاعات پوشش اراضی ایجاد کرده است. علاوه بر تصاویر چندطیفی و ابرطیفی، داده‌های حاصل از سامانه لیدار نیز امکان دستیابی به اطلاعات ارتفاعی دقیق را فراهم می‌کنند که در کنار اطلاعات طیفی، قابلیت شناسایی عوارض شهری را به میزان قابل توجهی افزایش می‌دهد. با وجود این پیشرفت‌ها، پیچیدگی ساختار شهرها، تنوع عوارض مصنوعی و طبیعی، شباهت طیفی بسیاری از پدیده‌ها و تغییرات مداوم محیط شهری باعث شده است که طبقه‌بندی دقیق پوشش اراضی همچنان یکی از چالش‌های مهم در سنجش از دور باقی بماند.

    روش‌های سنتی استخراج اطلاعات از تصاویر ماهواره‌ای عمدتاً بر پایه تفسیر بصری یا طبقه‌بندی‌های آماری انجام می‌شوند. هرچند در برخی شرایط تفسیر انسانی می‌تواند نتایج مناسبی ارائه دهد، اما با افزایش حجم داده‌های سنجش از دور، این روش‌ها دیگر پاسخگوی نیازهای امروزی نیستند. پردازش دستی تصاویر علاوه بر زمان‌بر بودن، وابستگی زیادی به تجربه کاربر داشته و احتمال بروز خطاهای انسانی را افزایش می‌دهد. به همین دلیل توسعه روش‌های خودکار مبتنی بر یادگیری ماشینی به یکی از مهم‌ترین راهکارهای افزایش سرعت، دقت و کارایی طبقه‌بندی تصاویر ماهواره‌ای تبدیل شده است.

    الگوریتم‌های یادگیری ماشینی طی سال‌های اخیر کاربرد گسترده‌ای در طبقه‌بندی تصاویر سنجش از دور پیدا کرده‌اند. روش‌هایی مانند ماشین بردار پشتیبان (SVM)، شبکه‌های عصبی مصنوعی (ANN) و الگوریتم بیشینه شباهت از جمله پرکاربردترین روش‌های طبقه‌بندی محسوب می‌شوند. با این حال، هر یک از این روش‌ها محدودیت‌هایی مانند نیاز به داده‌های آموزشی زیاد، حساسیت به تنظیم پارامترها، پیچیدگی محاسباتی و کاهش دقت در برخی شرایط دارند. این محدودیت‌ها موجب شده است که پژوهشگران به دنبال استفاده از الگوریتم‌های جدیدتر با عملکرد بهتر باشند.

    یکی از الگوریتم‌های نوین یادگیری ماشینی که در سال‌های اخیر توجه بسیاری از محققان را به خود جلب کرده، الگوریتم جنگل تصادفی (Random Forest) است. این الگوریتم با بهره‌گیری از مجموعه‌ای از درخت‌های تصمیم و ترکیب نتایج آن‌ها، امکان انجام طبقه‌بندی با دقت بالا و پایداری مناسب را فراهم می‌کند. ساختار ساده، مقاومت در برابر نویز، توانایی پردازش داده‌های با ابعاد زیاد، کاهش احتمال بیش‌برازش و نیاز کمتر به تنظیم پارامترها از مهم‌ترین ویژگی‌های این روش محسوب می‌شوند. به همین دلیل، جنگل تصادفی به عنوان یکی از الگوریتم‌های کارآمد برای تحلیل داده‌های سنجش از دور و طبقه‌بندی پوشش اراضی مورد توجه قرار گرفته است.

    هدف اصلی این پژوهش بررسی عملکرد الگوریتم جنگل تصادفی در بهبود طبقه‌بندی پوشش اراضی شهری با استفاده از تصاویر ماهواره‌ای و داده‌های کمکی است. در این تحقیق علاوه بر بررسی عملکرد مستقل الگوریتم RF، ترکیب آن با روش‌های شی‌گرا نیز مورد ارزیابی قرار گرفته تا میزان تأثیر این تلفیق بر افزایش دقت طبقه‌بندی مشخص شود. همچنین نتایج حاصل از این روش با سایر الگوریتم‌های متداول مانند ماشین بردار پشتیبان، شبکه عصبی مصنوعی و روش بیشینه شباهت مقایسه شده است تا مناسب‌ترین روش برای استخراج اطلاعات پوشش اراضی شهری معرفی شود.

    یکی از تفاوت‌های مهم این پژوهش نسبت به بسیاری از مطالعات گذشته، استفاده هم‌زمان از طبقه‌بندی پیکسل‌مبنا و طبقه‌بندی شی‌مبنا است. در روش‌های پیکسل‌مبنا، هر پیکسل به صورت مستقل و تنها بر اساس ویژگی‌های طیفی خود طبقه‌بندی می‌شود؛ در حالی که در محیط‌های شهری بسیاری از عوارض از مجموعه‌ای از پیکسل‌ها تشکیل شده‌اند و اطلاعات هندسی، بافت، شکل و ارتباط فضایی میان آن‌ها اهمیت زیادی دارد. به همین دلیل، استفاده از روش شی‌گرا می‌تواند با در نظر گرفتن ویژگی‌های بیشتری از عوارض، دقت طبقه‌بندی را افزایش دهد.

    در این تحقیق، ابتدا تصویر ماهواره‌ای با استفاده از فرآیند قطعه‌بندی به مجموعه‌ای از اشیای تصویری تبدیل شده است. سپس برای هر شی ویژگی‌های مختلفی شامل ویژگی‌های طیفی، مکانی، هندسی، بافتی و ارتفاعی استخراج شده و این ویژگی‌ها به عنوان ورودی الگوریتم‌های طبقه‌بندی مورد استفاده قرار گرفته‌اند. این رویکرد باعث می‌شود تصمیم‌گیری تنها بر اساس مقادیر عددی پیکسل‌ها انجام نشود، بلکه ویژگی‌های واقعی عوارض نیز در فرآیند طبقه‌بندی لحاظ گردد.

    یکی دیگر از اهداف مهم پژوهش، بررسی نقش الگوریتم جنگل تصادفی در انتخاب ویژگی‌های مؤثر است. تصاویر ابرطیفی معمولاً دارای تعداد بسیار زیادی باند طیفی هستند که همه آن‌ها اطلاعات مفید و کاربردی تولید نمی‌کنند. وجود باندهای غیرضروری علاوه بر افزایش حجم محاسبات، ممکن است موجب کاهش دقت طبقه‌بندی نیز شود. الگوریتم جنگل تصادفی با ارزیابی میزان اهمیت هر ویژگی، امکان انتخاب مناسب‌ترین باندها و حذف ویژگی‌های کم‌اهمیت را فراهم می‌کند. این موضوع علاوه بر افزایش سرعت پردازش، موجب بهبود عملکرد الگوریتم‌های طبقه‌بندی نیز می‌شود.

    از دیگر ویژگی‌های این تحقیق، استفاده از داده‌های لیدار در کنار تصاویر ابرطیفی است. اطلاعات ارتفاعی حاصل از لیدار به تفکیک بهتر ساختمان‌ها، پوشش گیاهی، راه‌ها و سایر عوارض شهری کمک می‌کند و در کنار اطلاعات طیفی تصاویر ماهواره‌ای، توانایی الگوریتم‌های یادگیری ماشینی را برای شناسایی دقیق کلاس‌های مختلف پوشش اراضی افزایش می‌دهد. ترکیب این داده‌ها با ویژگی‌های شی‌گرا و الگوریتم جنگل تصادفی، چارچوبی جامع برای بهبود طبقه‌بندی پوشش اراضی شهری ارائه کرده است که زمینه را برای افزایش دقت، کاهش خطاهای طبقه‌بندی و تولید نقشه‌های دقیق‌تر فراهم می‌کند.

    در این پژوهش، برای ارزیابی عملکرد روش‌های مختلف طبقه‌بندی، مجموعه‌ای از الگوریتم‌های متداول و پیشرفته یادگیری ماشینی مورد بررسی قرار گرفته‌اند تا نقاط قوت و ضعف هر یک در استخراج اطلاعات پوشش اراضی شهری مشخص شود. یکی از اهداف اصلی تحقیق، دستیابی به روشی است که علاوه بر افزایش دقت طبقه‌بندی، از نظر سرعت پردازش، سادگی اجرا و قابلیت استفاده در پروژه‌های عملی نیز عملکرد مناسبی داشته باشد. به همین دلیل، الگوریتم جنگل تصادفی در کنار روش‌هایی مانند ماشین بردار پشتیبان، شبکه‌های عصبی مصنوعی و الگوریتم بیشینه شباهت مورد مقایسه قرار گرفته است.

    در مرحله نخست، طبقه‌بندی تصاویر به صورت پیکسل‌مبنا انجام شده است. در این روش، هر پیکسل بر اساس ویژگی‌های طیفی خود به یکی از کلاس‌های پوشش اراضی اختصاص داده می‌شود. نتایج نشان داد که الگوریتم جنگل تصادفی در میان روش‌های بررسی‌شده، بالاترین دقت کلی را در حدود ۸۲ درصد به دست آورده است. این نتیجه بیانگر توانایی بالای الگوریتم RF در پردازش داده‌های پیچیده سنجش از دور و استخراج دقیق اطلاعات از تصاویر ماهواره‌ای است.

    در ادامه، روش طبقه‌بندی شی‌مبنا مورد بررسی قرار گرفت. برخلاف روش پیکسل‌مبنا، در این رویکرد ابتدا تصویر به مجموعه‌ای از اشیای همگن تقسیم شده و سپس هر شی با استفاده از ویژگی‌های مختلف طیفی، هندسی، مکانی، بافتی و ارتفاعی طبقه‌بندی می‌شود. این روش به دلیل استفاده از اطلاعات بیشتر درباره ساختار عوارض، توانایی بالاتری در شناسایی دقیق عناصر شهری دارد و می‌تواند بسیاری از خطاهای ناشی از شباهت طیفی را کاهش دهد.

    نتایج طبقه‌بندی شی‌مبنا نشان داد که الگوریتم ماشین بردار پشتیبان با دقت کلی حدود ۷۹ درصد بهترین عملکرد را در میان روش‌های شی‌مبنا داشته است و الگوریتم جنگل تصادفی نیز دقتی در حدود ۷۷ درصد را به دست آورده است. اگرچه در این مرحله اختلاف اندکی میان عملکرد دو الگوریتم مشاهده شد، اما پژوهش حاضر تنها به مقایسه الگوریتم‌ها محدود نبوده و با ارائه یک روش جدید مبتنی بر تلفیق قطعه‌بندی، ویژگی‌های شی‌گرا و الگوریتم جنگل تصادفی تلاش کرده است دقت طبقه‌بندی را بیش از پیش افزایش دهد.

    یکی از مهم‌ترین نوآوری‌های این تحقیق، استفاده از ویژگی‌های شی‌مبنا حاصل از قطعه‌بندی تصویر و ترکیب آن‌ها با الگوریتم‌های یادگیری ماشینی است. در این روش، ویژگی‌های متنوع استخراج‌شده از اشیای تصویری به عنوان ورودی طبقه‌بندی‌کننده‌ها مورد استفاده قرار گرفته و سپس نتایج با روش‌های متداول مقایسه شده است. این رویکرد باعث شده است که اطلاعات مکانی، بافتی، هندسی و ارتفاعی نیز در کنار اطلاعات طیفی در فرآیند تصمیم‌گیری نقش داشته باشند و کیفیت طبقه‌بندی افزایش یابد.

    نتایج حاصل از روش پیشنهادی نشان داد که استفاده از ویژگی‌های شی‌گرا موجب بهبود عملکرد تمامی الگوریتم‌های بررسی‌شده شده است. دقت کلی الگوریتم جنگل تصادفی از ۷۵ درصد به ۷۶ درصد افزایش یافته، دقت ماشین بردار پشتیبان از ۷۵ درصد به ۷۸ درصد رسیده، شبکه عصبی مصنوعی از ۷۰ درصد به ۷۵ درصد ارتقا یافته و الگوریتم بیشینه شباهت نیز از ۴۴ درصد به ۷۷ درصد افزایش یافته است. این نتایج نشان می‌دهد که انتخاب مناسب ویژگی‌ها و استفاده از اطلاعات شی‌گرا تأثیر قابل توجهی بر افزایش دقت طبقه‌بندی دارد.

    از دیگر بخش‌های مهم این پژوهش، بررسی نقش الگوریتم جنگل تصادفی در انتخاب ویژگی‌های مؤثر است. تصاویر ابرطیفی معمولاً شامل تعداد زیادی باند طیفی هستند که تمامی آن‌ها دارای ارزش اطلاعاتی یکسان نیستند. استفاده هم‌زمان از همه باندها علاوه بر افزایش زمان پردازش، ممکن است موجب کاهش دقت طبقه‌بندی نیز شود. الگوریتم RF با تعیین میزان اهمیت هر ویژگی، امکان حذف باندهای کم‌اهمیت و انتخاب مؤثرترین ویژگی‌ها را فراهم می‌کند. این فرآیند علاوه بر کاهش حجم محاسبات، باعث افزایش سرعت اجرای الگوریتم‌ها و بهبود کیفیت نتایج نیز شده است.

    در این تحقیق همچنین قابلیت الگوریتم جنگل تصادفی برای تولید نمونه‌های آموزشی جدید مورد بررسی قرار گرفته است. کیفیت داده‌های آموزشی یکی از عوامل تعیین‌کننده در عملکرد الگوریتم‌های یادگیری ماشینی محسوب می‌شود. پژوهش حاضر نشان می‌دهد که استفاده از احتمال تعلق کلاس‌ها در الگوریتم RF می‌تواند به تولید نمونه‌های آموزشی مناسب‌تر کمک کند و در نتیجه دقت طبقه‌بندی نهایی را افزایش دهد. این ویژگی یکی از مزیت‌های مهم جنگل تصادفی نسبت به بسیاری از روش‌های سنتی طبقه‌بندی محسوب می‌شود.

    یکی دیگر از دستاوردهای این تحقیق، بررسی هم‌زمان تصاویر ابرطیفی و داده‌های لیدار است. داده‌های لیدار اطلاعات ارتفاعی دقیقی از سطح زمین، ساختمان‌ها، پوشش گیاهی و سایر عوارض شهری ارائه می‌دهند و در کنار اطلاعات طیفی تصاویر ماهواره‌ای، امکان تفکیک دقیق‌تر کلاس‌های مختلف را فراهم می‌کنند. نتایج تحقیق نشان می‌دهد که تلفیق این داده‌ها همراه با ویژگی‌های شی‌گرا و الگوریتم جنگل تصادفی، نسبت به استفاده از هر یک از منابع اطلاعاتی به صورت مستقل، عملکرد بهتری در طبقه‌بندی پوشش اراضی شهری ایجاد می‌کند.

    یافته‌های این پژوهش بیانگر آن است که الگوریتم جنگل تصادفی علاوه بر برخورداری از ساختاری ساده و نیاز کمتر به تنظیم پارامترها، توانایی بالایی در پردازش داده‌های حجیم و پیچیده سنجش از دور دارد. این الگوریتم می‌تواند با دقت مناسب، سرعت بالا و مقاومت در برابر نویز، جایگزین مناسبی برای بسیاری از روش‌های پیچیده یادگیری ماشینی باشد. همچنین ترکیب این الگوریتم با روش‌های شی‌گرا و داده‌های کمکی مانند لیدار، موجب افزایش دقت استخراج اطلاعات و تولید نقشه‌های دقیق‌تر پوشش اراضی شهری می‌شود.

    در مجموع، نتایج این پایان‌نامه نشان می‌دهد که استفاده از روش پیشنهادی مبتنی بر تلفیق قطعه‌بندی تصویر، ویژگی‌های شی‌گرا، تصاویر ابرطیفی، داده‌های لیدار و الگوریتم جنگل تصادفی، می‌تواند عملکرد طبقه‌بندی پوشش اراضی شهری را از نظر دقت، سرعت و کارایی بهبود بخشد. این رویکرد ضمن کاهش محدودیت‌های روش‌های سنتی، امکان تولید نقشه‌های دقیق‌تر را برای کاربردهایی مانند مدیریت شهری، برنامه‌ریزی توسعه، پایش تغییرات محیطی، مدیریت منابع طبیعی و تصمیم‌گیری‌های مکانی فراهم می‌کند و می‌تواند به عنوان راهکاری مؤثر در پروژه‌های آینده سنجش از دور و پردازش تصاویر ماهواره‌ای مورد استفاده قرار گیرد.
